Description

Replace the legacy optimized Kimi K3 KDA prefill chain with FlashInfer BT16/Small-BH kernels and fused CuTe DSL convolution/input preparation. Prefill reads and updates resident recurrent-state pools directly, avoiding BF16-to-FP32 state staging and writeback while preserving continuation, replay-cache updates, and decode/verification behavior.

  • Vendor the two FlashInfer kernels at commit b8e81a7dae6c2aa5c9aa19c06e81e9a729271493 through the existing source-lock, compatibility-patch, and digest-check workflow. Remove the replaced prefill kernels.
  • Fuse short convolution, layout conversion, and input preparation; perform Q/K normalization inside FlashInfer and retain packed BF16/FP8 projection inputs.
  • Select Small-BH for eligible small batch/head workloads and BT16 otherwise. Reuse BT16 scheduling metadata across layers and cache fused-convolution specializations without retaining caller buffers.
  • Preserve low-rank gate projections, the current core-output contract, aligned generation indices, and replay-copy support.
  • Reuse fused-convolution compilations across token counts, request counts, and state-pool capacities using symbolic runtime extents; retain layout and alignment specializations.
  • Add kernel/module parity and state-continuation coverage. Move single-GPU KDA cases into the GB300 pre-merge list and update B200 coverage.

Test Coverage

  • Added/updated tests cover FlashInfer prefill, fused convolution, fresh and continuation state, untouched slots, packed layouts, changing metadata, cache behavior, and subsequent decode/verification.
  • On this branch: pre-commit hooks, vendored-source integrity, and git diff --check pass. Independently reconstructing the pinned upstream files plus the recorded patch reproduces both vendored kernels byte-for-byte.
  • Rebuilt rebased commit 0cebbea6df666042fba3c4d633cc7be20932bc0b for 100-real and reran the KDA unit suite plus FP8 packed-prefill tests on shared B200 (b200-02, GPU 0): 293 passed, 1 skipped, 0 failed, 7 warnings, in 249.84 seconds. The single skip is the MXFP8 verify epilogue test that requires Rubin SM107.
  • Command: CUDA_VISIBLE_DEVICES=0 python3 -m pytest tests/unittest/_torch/modules/kimi_kda tests/unittest/_torch/modeling/test_kimi_kda_fp8_packed_prefill.py -ra --junitxml=tmp/pr20653-b200-rebase/results.xml.
  • Environment: editable installation of the rebased commit with freshly rebuilt extensions, Torch 2.14.0a0+b2c75dd062.nv26.09, CUTLASS DSL 4.8.0, FLA 0.5.2, and FlashInfer 0.6.18. Historical performance results below are not new measurements on this branch.
  • Before rebasing, follow-up commit 16545a069eb6a5e7fa5e84eaa5a78fe22f20b762: all 18 existing fused-convolution tests passed on B200. A temporary regression test reproduced the original new-shape graph-capture failure, then passed all 3 cases with the fix (aligned vector, unaligned source/padded state, and scalar/strided layouts). It changes token count, request count, and pool capacity between warmup and capture and checks Q/K/V and state against the reference. The temporary test was removed after validation as requested.

Performance Results

These are prior implementation measurements, not new benchmark runs on this PR.

GB300 local KDA module

The full local module includes FP8 block-scaled projections, convolution, recurrent prefill, and output processing with BF16 activations/state. TP16 represents one rank with 6 local heads, excluding communication; TP1 has 96 heads. Batched cases used revision 7cfd6a740e6dc982c813268a09edc22db9a25bb1; single-request cases used 2596c70ca9cdf7d4a493fb045a3ae1a9353e03f4.

Workload (requests × input tokens) Legacy mean (ms) FlashInfer only mean (ms) FI-only speedup FI + fused conv/post mean (ms) Combined speedup
TP16, 8×1024 0.428 0.365 1.171–1.175× 0.313 1.361–1.375×
TP16, 1×8192 0.637 0.538 1.183–1.185× 0.501 1.268–1.271×
TP1, 8×1024 4.474 3.913 1.142–1.145× 3.011 1.473–1.493×
TP1, 8×2048 8.791 7.772 1.125–1.137× 6.058 1.443–1.457×
TP1, 1×8192 4.006 3.617 1.106–1.112× 3.039 1.312–1.323×

Means average 1,200 samples per implementation/workload. Speedup ranges are matched per-process median ratios across fresh/continuation and cold/warm conditions in three independent processes; they are observed ranges, not confidence intervals. Each process used 100 shuffled complete rounds and an identical-baseline control. Timing used CUPTI graph timestamps with one invocation per graph, excluding index/offset preparation, allocation, compilation, tuning, state restoration, and cache eviction. Separate profiler captures verified dispatch. Batched and single-request comparisons used different GB300 GPUs, with implementations compared on the same GPU within each workload.

A historical integration check at bca82fac00384dbade3d1ac7a4eceeed724efe1a preserved the experimental fused path's full-module latency within 0.41% for TP16/TP1 8×1024. These local module gains do not imply equivalent serving-throughput gains.

Fixed-length serving on GB300

Matched configurations used 131,072 input tokens / 2 output tokens, concurrency 96, and 768 requests per implementation. Inputs were synthetic random token IDs with client-side tokenization, seed 0, length range ratio 0, and EOS ignored. The disaggregated topology used CTX TP16 with attention DP and GEN TP8 across 6 nodes / 24 GB300 GPUs, including routing and KV transfer. CTX used 96 KDA heads per rank, chunked prefill, an 8192-token budget, and no CUDA graphs. Profiling and accuracy evaluation were disabled; GPU clocks were unlocked.

  • Baseline revision: 9a69086b455d6300e3cc8b2dafe81b1cb7c2dc4d.
  • Optimized revision: a0fdbaf7b00c493c0503469940859ad32c6351d9.
  • Both used public CUTLASS DSL 4.8.0, checkpoint nvidia_kimi-k3-nvfp4/hf/hf-b2428a0_orig, and compile/runtime image pytorch-26.05-py3-sbsa-ubuntu24.04-skip-tritondevel-202607211045-16608.sqsh.
Implementation JHB job Input tokens/s ↑ Requests/s ↑ Mean TTFT (s) ↓
Baseline 1064918 81,384 0.621 146.40
Optimized 1064919 83,859 0.640 142.03
Change — +3.04% (1.0304×) +3.04% −2.99%

Both jobs completed successfully; all 768 requests succeeded with exactly the specified input/output lengths. Input throughput is total input tokens divided by measurement duration, excluding output tokens. It is not explicitly cache-subtracted, and the client summary does not establish actual cache-read counts.

This is one run per implementation on separate allocations with unlocked clocks. Client-observed TTFT at concurrency 96 includes queueing and serving overhead and does not isolate kernel latency. No confidence interval or general full-model speedup is claimed.

For comparison, a separate three-run AgentX multi-turn trace comparison at the same revisions averaged 31,673 uncached input tokens/s for baseline versus 30,950 for optimized (−2.28%). The fixed-length gain should therefore not be generalized to that workload.

Historical correctness context

At revision a0fdbaf7b00c493c0503469940859ad32c6351d9, the B200 KDA unit suite reported 266 passed, 14 skipped, and 0 failed; skips were SM103-only compact-head selector sweeps. Historical B200/GB300 microbenchmark checks covered eight input distributions and three seeds: module outputs and recurrent state met cosine >0.999 and relative L2 <0.03, with worst observed relative L2 2.09%. Elementwise checks at rtol=atol=0.01 were diagnostic and had nonzero mismatches. SM107 and full-model GSM8K accuracy remain unvalidated.

Dev Engineer Review

  • Replaces the legacy KDA prefill chain with FlashInfer BT16 and Small-BH kernels.
  • Adds indexed recurrent-state pool access, fused width-4 convolution, in-place state updates, and cached kernel specializations.
  • Changes metadata preparation to reusable 16-token scheduling buffers.
  • Removes legacy fused K1–K4, Akk inversion, K4 persistent, scratch-cache, and PTX patch implementations.
  • Main risks are numerical parity, state indexing, CUDA Graph replay, specialization caching, and changed public APIs.
  • Reported B200 testing: 293 passed, 1 skipped, and 0 failed. SM107 and full-model accuracy remain unvalidated.
  • Review finding severity counts are unavailable.

QA Engineer Review

The change adds coverage for FlashInfer prefill, fused convolution, metadata generation, decode-state parity, BF16 state pools, replay, input immutability, padding, and mixed initial states. It removes direct coverage for bounded caches, host metadata, PTX patch behavior, and legacy state reuse. Coverage is needs follow-up.

B200 and GB300 CI lists include the new KDA prefill, convolution, metadata, cache-soundness, state-parity, decode-state, verification, MTP, and BF16 state-pool tests. The GB300 multi-GPU list retains BF16 state-pool and mixed-batch layout tests. The CPU list still references the deleted test_kimi_k3_kda_ptx_patch.py, which requires cleanup. The reported B200 command does not establish results for every integration entry.

Merge Risk: 🟡 Moderate · up to 0cebb

The new KDA prefill path can produce corrupted output and recurrent state if a piecewise-compiled graph is replayed for a batch with a longer sequence than the one it was captured with. The serving paths that rerun this step eagerly are not affected. Separately, one BF16 test check cannot detect writes to state rows that should remain unchanged. Confirm or fix the replay bound for the piecewise path before merging.

The tests cover prefill parity, beta layouts, graph replay, fused-convolution numerics, aliasing rejection, continuation decode and verify, cache updates, state handling, packed-length refresh, and input immutability. The discoverable new tests include test_indexed_prefill_matches_reference, test_prefill_beta_views_match_compact_eager_and_graph, test_module_continuation_decode_and_verify, test_graph_replay_refreshes_packed_lengths, and test_production_forward_updates_live_cache.

The FLA prefill path is already exercised. Model finalization builds _packed_conv_weight unconditionally, so remove the claimed FLA assertion gap and the proposed monkeypatch test.

l0_gb300.yml lists the relevant KDA prefill, fused-convolution, and related tests. l0_b200.yml lists test_kda_prefill_op.py, test_kda_flashinfer_prefill.py, and test_kda_fused_prefill_conv.py.

One gap remains: the fused-convolution graph tests warm up and capture with the same total token count and batch size. They vary sequence metadata and layouts, but do not change (T, B) between warmup and capture. Add a fused-convolution case that changes (T, B) and asserts outputs and state.

@PerkzZheng, could you help to review this PR as trt-llm-torch-attention-devs? Thanks~

Assignment explanation
Componentsruntime/metadata-workspaces (55%); integration/attention-tests (40%); integration/dependencies (5%)
Tagsalgorithm:linear (100%); phase:prefill (100%); features:cuda-graphs (100%)
PR effort8 points — Reworks an existing KDA prefill implementation without introducing a model architecture. Reviewing schedule semantics, state layout and precision, stable buffer lifetimes, and graph replay requires deep contract reasoning; vendored file volume alone does not determine effort.
ImportanceImportant — The metadata rewrite changes chunk alignment, execution ordering, and asynchronous schedule transfers. Added tests establish sensitive contracts for indexed BF16/FP32 recurrent-state mutation and replay with changing sequence boundaries.

Move importorskip("fla") into the FLA-dependent tests.

The module-level skip prevents the direct kda_prefill tests from running when fla is unavailable. Only the continuation and production-forward tests select the FLA baseline.

Suggested fix

-pytest.importorskip("fla")
-
 from tests.unittest._torch.modules.kimi_kda.kda_module_test_utils import (

 def test_module_continuation_decode_and_verify(conv_mode: str) -> None:

@@
 def test_production_forward_updates_live_cache(state_dtype: torch.dtype) -> None:
+ pytest.importorskip("fla")
"""The model entry point updates recurrent, convolution and replay caches."""

Test coverage summary: The module adds indexed prefill, beta-view, continuation/decode/verify, graph-replay, and live-cache tests. It covers state rows, padding, input immutability, noncontiguous beta layouts, packed lengths, continuation, and cache updates. The module is listed in l0_b200.yml and l0_gb300.yml. Validation-error paths remain uncovered here.

Remove the module-level pytest.importorskip("fla") and add it at the start of
test_module_continuation_decode_and_verify and
test_production_forward_updates_live_cache. Leave the direct kda_prefill tests
runnable without FLA while preserving skips for the tests that select the FLA
baseline.
